Google DeepMind Unveils EmbeddingGemma 2: A Compact Multimodal AI Redefining On-Device Embeddings

Google DeepMind has introduced EmbeddingGemma 2, an advanced open multimodal embedding model. This new offering, featuring 740 million parameters, is engineered to convert diverse data types—including text, code, images, video, and audio—into a unified 768-dimensional vector space. Built upon the Gemma 4 architecture, EmbeddingGemma 2 is poised to enhance on-device search, classification tasks, and privacy-centric Retrieval Augmented Generation (RAG) applications, operating under an Apache 2.0 license.

Understanding Embedding Models

Embedding models function by transforming complex content into numerical vectors, which effectively capture the underlying meaning. When items are semantically similar, their corresponding vectors appear closer together in this high-dimensional space, simplifying search and comparison processes. In RAG pipelines, these generated vectors enable large language models to access and retrieve novel information beyond their initial training data. Performing these embedding operations locally on a device offers significant advantages, such as enhanced data privacy, reduced latency, and robust offline functionality.

A Unified Vector Space for All Modalities

A key innovation of EmbeddingGemma 2 lies in its ability to process multiple modalities within a single vector space. This allows for cross-modal interactions, where, for instance, a text query could effectively retrieve a relevant photograph, or a spoken memo might locate a specific video clip. The model also supports interleaved inputs—such as a product description combining text, images, and a demonstration video—generating a single cohesive embedding.

The architecture is modular, comprising three distinct components:

  • Text and Code Backbone: This core module contains 270 million parameters, split between a 130M-parameter transformer and a 140M-parameter embedder.
  • Vision Encoder: An optional component with 170 million parameters.
  • Audio Encoder: Another optional component, housing 300 million parameters.

Developers can tailor the model's footprint by loading only the necessary encoders, scaling from a 270M-parameter text-only setup to the full 740M multimodal configuration. All configurations share the same coherent vector space, ensuring compatibility between embeddings generated by different setups.

The model boasts an expanded context window of 8,192 tokens, a four-fold increase over its predecessor. This capacity can accommodate approximately 29 images, 58 video frames, or 5.5 minutes of audio, depending on the modality.

Benchmarking Performance and Efficiency

Internal evaluations by Google research teams indicate that EmbeddingGemma 2 achieves leading performance among sub-1 billion parameter multimodal embedders across benchmarks like MTEB Code and MAEB. Notably, it demonstrated a significant 9.92 point improvement in code retrieval, approximately a 14% gain, while maintaining strong multilingual text quality. While larger models still hold leads in some categories, EmbeddingGemma 2 presents a compelling balance of capability and efficiency.

Designed with mobile and desktop environments in mind, EmbeddingGemma 2 exhibits impressive resource efficiency. When quantized, the text-only weights require around 191MB of active RAM on a Pixel 11 Pro, with the full multimodal model needing approximately 567MB. The Google AI Edge team reported an image processing time of 37.3 milliseconds per image on a MacBook M5 Pro GPU.

Furthermore, Matryoshka Representation Learning (MRL) empowers developers to truncate embedding vectors to smaller dimensions (512, 256, or 128), significantly reducing storage requirements by up to six times. This flexibility allows optimization for different use cases; for example, reducing dimensions to 256 causes only a minor drop in MTEB multilingual scores.

Deployment and Accessibility

EmbeddingGemma 2 is readily available for deployment today, with model weights accessible on platforms like Hugging Face and Kaggle. Builds are supported across a variety of frameworks and tools, including Ollama, llama.cpp GGUF, LiteRT, sentence-transformers v6.1.0+, and Transformers. Vector storage solutions such as Qdrant are compatible, and Unsloth provides options for fine-tuning. Upcoming support for ML Kit on Android, complete with NPU acceleration, is anticipated in the coming weeks.

Developers can integrate the model using straightforward Python commands, enabling quick implementation for various applications. For instance, querying and document embedding can be performed using the sentence-transformers library, facilitating semantic similarity searches.

Summary of Key Advancements

  • An open 740M-parameter model processes text, code, images, video, and audio within a unified 768-dimensional space.
  • Its modular encoder design allows for scalable deployment, from 270M parameters for text-only tasks to the full 740M for complete multimodal capabilities.
  • Significant performance gains were observed in code retrieval benchmarks.
  • The model maintains a compact memory footprint, suitable for on-device applications, requiring approximately 191MB for text-only and 567MB for full multimodal use with quantization.
